Build an AI Agent Evaluation Platform

Build Argus: instrument, test, and score AI agents with tracing and MLflow.

Introduction

30 Second Summary

AI agents are powerful, but they break in unpredictable ways. A chatbot that worked perfectly yesterday might hallucinate, call the wrong tool, or get stuck in an infinite loop today.

In this project, you will build Argus, a production-grade evaluation platform that runs AI agents against structured test suites, classifies their failures into categories, and detects reliability regressions across agent versions.

What You'll Build

Argus is a FastAPI application backed by PostgreSQL, Redis, and MLflow that instruments agent execution with OpenTelemetry tracing, computes reliability metrics, and exposes REST APIs for inspection and comparison.

By the end of this project, you'll have:

  • A Docker Compose stack running PostgreSQL, Redis, and an MLflow tracking server for persistence and experiment tracking.
  • A traced AI agent built with LangGraph that captures every model call, tool execution, and token count as OpenTelemetry spans.
  • An evaluation engine that runs test suites, computes success rate and hallucination metrics, and classifies failures into structured categories using deterministic signals.
  • An experiment tracking system that compares agent versions, computes a composite reliability score, and detects statistical regressions.
  • Secret Mission: An adversarial testing engine and CI reliability gate that blocks deployment when agent quality regresses.

Are there any prerequisites?

You should have Python 3.12+ and Docker with Docker Compose installed on your machine. Familiarity with Python async patterns and REST APIs will help you move through the project smoothly.

Set Up Infrastructure and Project Scaffold

An evaluation platform needs persistent storage for test results, a cache for task coordination, and an experiment tracking server to compare agent versions over time.

In this step, you will scaffold the project directory, install all Python dependencies, launch three infrastructure services with Docker Compose, and create the FastAPI application entrypoint that ties everything together.

In this step, get ready to:
  • Create the project directory, virtual environment, and install dependencies.
  • Launch PostgreSQL, Redis, and MLflow containers with Docker Compose.
  • Create the FastAPI application with database initialization and a health endpoint.
Create the project directory and install dependencies

Every Python project starts with a clean directory, an isolated virtual environment, and a locked set of dependencies.

  • Press Cmd+Space (macOS) or the Windows key (Windows) to open your search bar.
  • Type Terminal and press Enter to open it.
  • Move to your Desktop by running this command:
cd ~/Desktop
  • Create your project folder, subdirectories, and move into it by running these commands:
mkdir argus-platform
cd argus-platform
mkdir -p argus datasets
  • Confirm the directories exist by running:
ls

You should see argus and datasets in the output.

  • Create a Python virtual environment by running:

macOS

python3 -m venv .venv
source .venv/bin/activate

Windows

py -3.12 -m venv .venv
.venv\Scripts\activate

Your terminal prompt should now show (.venv) at the beginning, confirming the virtual environment is active.

Don't see (.venv) in your prompt?

Make sure you ran both commands. The first creates the environment. The second activates it. On Windows, you may need to run Set-ExecutionPolicy RemoteSigned -Scope CurrentUser first if activation is blocked.

  • Create the requirements.txt file inside your argus-platform folder. Open VS Code by pressing Cmd+Space (macOS) or the Windows key, typing VS Code, and pressing Enter.
  • Click File in the top menu bar.
  • Click Open Folder.
  • Select the argus-platform folder on your Desktop, then click Open.
  • In the Explorer sidebar, click the new file icon next to ARGUS-PLATFORM and name it requirements.txt.
  • Paste the following content into requirements.txt:
fastapi[standard]==0.139.0
langgraph==1.2.8
langchain-core>=0.3.0
psycopg[binary,pool]==3.3.4
redis==8.0.1
mlflow==3.14.0
opentelemetry-api>=1.20.0
opentelemetry-sdk>=1.20.0
numpy>=1.26.0
scipy>=1.12.0
pydantic-settings>=2.0.0
httpx>=0.23.0

What are these dependencies?

  • fastapi is the web framework for your evaluation API.
  • langgraph and langchain-core power the agent under test.
  • psycopg connects to PostgreSQL for storing traces and experiments.
  • mlflow tracks experiments and compares agent versions.
  • opentelemetry-api and opentelemetry-sdk provide the tracing layer for agent execution.
  • scipy and numpy handle statistical regression detection.
  • Save requirements.txt.

  • Install all dependencies by running this command in your terminal (make sure (.venv) is visible in your prompt):
pip install -r requirements.txt

This takes a minute or two. You should see a success message ending with Successfully installed followed by the list of packages.

Installation failing?

Confirm your virtual environment is active by checking for (.venv) in your prompt. If you see permission errors, do not use sudo. Deactivate and recreate the venv instead.

Launch infrastructure services with Docker Compose

Argus stores traces and experiment results in PostgreSQL, uses Redis for coordination, and runs an MLflow tracking server for experiment comparison.

Docker Compose lets you define and start all three services with a single command.

  • In VS Code's Explorer sidebar, click the new file icon next to ARGUS-PLATFORM and name it docker-compose.yml.
  • Paste the following configuration into docker-compose.yml:
services:
  postgres:
    image: postgres:16
    environment:
      POSTGRES_USER: argus
      POSTGRES_PASSWORD: argus_dev
      POSTGRES_DB: argus

What does this configure?

  • postgres runs PostgreSQL 16 with a database called argus, exposed on port 5432. A healthcheck confirms it is accepting connections.
  • redis runs the latest Redis image on port 6379. The healthcheck pings it every 5 seconds.
  • mlflow runs the MLflow tracking server on port 5001, storing metadata in the PostgreSQL database. It waits for postgres to be healthy before starting.
  • Save docker-compose.yml.

Create the FastAPI application entrypoint

With infrastructure running, you need application code that connects to these services on startup.

You will create four files: an empty package marker, a settings module, a database helper, and the FastAPI application itself.

  • In VS Code's Explorer sidebar, right-click the argus folder and select New File. Name it __init__.py and leave it empty. This marks argus as a Python package.
  • Right-click the argus folder again, select New File, and name it config.py.
  • Paste the following into argus/config.py:
from pydantic_settings import BaseSettings

class Settings(BaseSettings):
    # Connection strings for infrastructure services
    database_url: str = "postgresql://argus:argus_dev@localhost:5432/argus"
    redis_url: str = "redis://localhost:6379/0"
    mlflow_tracking_uri: str = "http://localhost:5001"
    # Agent execution limits
    max_agent_steps: int = 10
    target_latency_ms: float = 5000.0
    cost_budget: float = 1.0
    # Statistical threshold for regression detection
    regression_alpha: float = 0.05

    class Config:
        env_prefix = "ARGUS_"

settings = Settings()

What does this code do?

Settings uses pydantic-settings to load configuration from environment variables prefixed with ARGUS_. The defaults match your Docker Compose services, so everything works locally without extra configuration.

The settings instance at the bottom is a singleton you will import throughout the project.

  • Save argus/config.py.

  • Create another file in the argus folder named db.py.

    metrics JSONB,
    failures JSONB,
    reliability_score FLOAT,
    mlflow_run_id TEXT,
    created_at TIMESTAMP DEFAULT NOW()
);
"""

What do these tables store?

  • datasets holds the test suites you will run against your agent.
  • traces stores the full span hierarchy from each agent execution (model calls, tool calls, latency).
  • experiments records the aggregate metrics, failure distribution, and reliability score for each evaluation run.
  • Add the connection helpers below the SCHEMA_SQL string in the same file:

async def init_db():
    # Connect and run schema creation on app startup
    async with await psycopg.AsyncConnection.connect(
        settings.database_url, row_factory=dict_row
    ) as conn:
        await conn.execute(SCHEMA_SQL)
        await conn.commit()

@asynccontextmanager
async def get_conn():
    # Reusable async context manager for database access
    async with await psycopg.AsyncConnection.connect(
        settings.database_url, row_factory=dict_row
    ) as conn:
        yield conn

What do these functions do?

init_db() runs the schema SQL once when the server starts, creating all tables if they do not already exist.

get_conn() is an async context manager that gives any endpoint a database connection. Using dict_row means query results come back as Python dictionaries instead of tuples.

app = FastAPI(title="Argus", version="1.0.0", lifespan=lifespan)

What does this code do?

The lifespan function runs once when the server starts. It creates all database tables via init_db() and points MLflow at the tracking server you launched with Docker Compose.

The /health endpoint gives you a quick way to confirm the server is running. Some imports (json, uuid, HTTPException, BaseModel) will be used in later steps when you add more endpoints.

help me get the FastAPI server running for Argus

Your infrastructure is running and your API is live. Next up, you will build the agent under test and instrument it with tracing spans so every model call and tool execution is captured.

Build the Agent Under Test with Tracing

Your infrastructure is running and the API skeleton responds to health checks. Now you need an agent to actually evaluate.

In this step, you will build a mock AI agent with four tools, instrument every execution with span-level tracing, and expose an API endpoint that runs the agent and stores the full trace in PostgreSQL. The mock approach means zero API costs and fully deterministic test runs.

In this step, get ready to:
  • Build a mock model and four injectable tools.
  • Construct an agent loop with OpenTelemetry-style span tracing.
  • Expose an API endpoint that runs the traced agent and persists spans.
Build the mock model and tool functions

A real evaluation platform tests agents against known inputs with expected outputs. Using a mock model that returns scripted responses gives you full control over what the agent "thinks" without spending money on API calls.

  • Create the agent package inside your project by running these commands:
mkdir -p argus/agent
touch argus/agent/__init__.py
  • Confirm the files exist by running:
ls argus/agent/

You should see __init__.py in the output.

  • Create a new file called argus/agent/mock_model.py and add the following code:
import time
from dataclasses import dataclass, field

@dataclass
class MockToolCall:
    id: str
    name: str
    args: dict

@dataclass
class MockModelResponse:
    content: str = ""
    tool_calls: list[MockToolCall] = field(default_factory=list)
    prompt_tokens: int = 50
    completion_tokens: int = 30

class MockChatModel:
    def __init__(self, responses: list[MockModelResponse]):
        self._responses = responses
        self._call_index = 0

    def invoke(self, messages: list[dict]) -> MockModelResponse:
        if self._call_index >= len(self._responses):
            return MockModelResponse(content="I cannot help further.")
        response = self._responses[self._call_index]
        self._call_index += 1
        return response

    def reset(self):
        self._call_index = 0

What does this code do?

MockToolCall represents a tool invocation the model wants to make (name + arguments). MockModelResponse bundles the model's text output with any tool calls and token counts.

MockChatModel steps through a scripted list of responses. Each call to invoke() returns the next scripted response. This makes agent behaviour fully deterministic and reproducible across test runs.

  • Save argus/agent/mock_model.py.

Now you need the tools the agent will call. Each tool simulates a real service (knowledge base, calculator, API, database) and accepts a fail_mode parameter so you can inject failures during evaluation.

  • Create a new file called argus/agent/tools.py and add the exception class and first two tools:
import time
import json

class ToolExecutionError(Exception):
    pass

def search_knowledge_base(query: str, fail_mode: str | None = None) -> str:
    if fail_mode == "timeout":
        time.sleep(6)
        raise TimeoutError("Knowledge base search timed out")
    if fail_mode == "empty":
        return ""
    if fail_mode == "error":
        raise ToolExecutionError("Knowledge base unavailable")
    results = {
        "python async": "Python asyncio provides concurrent execution using async/await syntax.",
        "machine learning": "Machine learning is a subset of AI focused on learning from data.",
        "kubernetes": "Kubernetes is a container orchestration platform for deploying applications.",
        "default": "No specific results found for this query.",
    }
    for key, value in results.items():
        if key in query.lower():
            return value
    return results["default"]

def calculate(expression: str, fail_mode: str | None = None) -> str:
    if fail_mode == "error":
        raise ToolExecutionError("Calculator service unavailable")
    if fail_mode == "wrong":
        return "42"
    try:
        allowed_chars = set("0123456789+-*/.(). ")
        if not all(c in allowed_chars for c in expression):
            return f"Error: invalid expression '{expression}'"
        result = eval(expression)
        return str(result)
    except Exception as e:
        return f"Error: {e}"

What does this code do?

  • ToolExecutionError is a custom exception that tools raise for non-timeout infrastructure failures.
  • search_knowledge_base matches the query against a small hardcoded knowledge base. The fail_mode parameter lets tests inject timeouts, empty results, or errors.
  • calculate evaluates a math expression after sanitizing for safe characters. Passing fail_mode="wrong" returns a deliberately incorrect answer for testing hallucination detection.
  • Add the remaining two tools and the tool registry below the calculate function in the same file:
def fetch_api_data(endpoint: str, fail_mode: str | None = None) -> str:
    if fail_mode == "timeout":
        time.sleep(6)
        raise TimeoutError("API request timed out")
    if fail_mode == "malformed":
        return "{{invalid json response"
    if fail_mode == "error":
        raise ToolExecutionError("API endpoint unreachable")
    mock_apis = {
        "/weather": json.dumps({"temp": 72, "condition": "sunny", "city": "Austin"}),
        "/stock": json.dumps({"symbol": "AAPL", "price": 198.50, "change": "+1.2%"}),
        "/user": json.dumps({"name": "Alice", "role": "engineer", "active": True}),
    }
    for path, response in mock_apis.items():
        if path in endpoint:
            return response
    return json.dumps({"error": "endpoint not found"})

def lookup_database(table: str, query_filter: str, fail_mode: str | None = None) -> str:
    if fail_mode == "error":
        raise ToolExecutionError("Database connection failed")
    if fail_mode == "timeout":
        time.sleep(6)
        raise TimeoutError("Database query timed out")
    mock_data = {
        "users": [{"id": 1, "name": "Alice"}, {"id": 2, "name": "Bob"}],
        "orders": [{"id": 101, "user_id": 1, "total": 59.99}],
        "products": [{"id": 1, "name": "Widget", "price": 9.99}],
    }
    data = mock_data.get(table, [])
    return json.dumps(data)

TOOL_REGISTRY = {
    "search_knowledge_base": search_knowledge_base,
    "calculate": calculate,
    "fetch_api_data": fetch_api_data,
    "lookup_database": lookup_database,
}

What does this code do?

  • fetch_api_data simulates external API calls. The malformed fail mode returns invalid JSON to test how agents handle broken responses.
  • lookup_database returns mock rows from predefined tables.
  • TOOL_REGISTRY maps tool names to their callable functions. The agent loop uses this to dispatch tool calls by name.
  • Save argus/agent/tools.py.

You won't see a change yet. The next chunk uses these tools inside the agent loop.

Build the tracing layer and agent loop

The agent loop cycles between model calls and tool execution until the model returns a final text response. Every iteration generates OpenTelemetry-style spans that record exactly what happened: which model was called, what tokens it used, which tools ran, and how long each took.

  • Create a new file called argus/agent/graph.py and add the data structures that represent spans and traces:
import time
import uuid
from dataclasses import dataclass, field
from typing import Any

from argus.agent.mock_model import MockChatModel, MockModelResponse, MockToolCall
from argus.agent.tools import TOOL_REGISTRY, ToolExecutionError
from argus.config import settings

@dataclass
class Span:
    span_id: str
    parent_id: str | None
    name: str
    kind: str
    start_time: float
    end_time: float = 0.0
    attributes: dict = field(default_factory=dict)
    status: str = "OK"
    error: str | None = None

@dataclass
class AgentTrace:
    trace_id: str
    spans: list[Span] = field(default_factory=list)
    total_prompt_tokens: int = 0
    total_completion_tokens: int = 0
    output: str = ""
    steps: int = 0

What does this code do?

  • Span mirrors the OpenTelemetry span model. Each span has a parent (for hierarchy), a kind (CLIENT for outgoing calls, INTERNAL for local work), timing data, and a dict of attributes for recording metrics.
  • AgentTrace collects all spans from a single agent execution along with aggregate token counts and the final output.
  • Add the run_agent function below the AgentTrace dataclass in the same file:
def run_agent(
    model: MockChatModel,
    input_message: str,
    tool_fail_modes: dict[str, str] | None = None,
) -> AgentTrace:

What's happening here?

The agent loop has three phases per iteration:

  • Call the model and record a CLIENT span with token counts and latency.
  • If the model returns tool calls, execute each tool with its own INTERNAL span. Inject fail_mode if configured.
  • If the model returns only content (no tool calls), the loop ends. If it exceeds max_agent_steps, the while/else clause marks it as a loop failure.

The root span gets inserted at index 0 after the loop completes, giving you a parent-child hierarchy: one root with model and tool spans as children.

Why custom spans instead of the OpenTelemetry SDK?

The OpenTelemetry GenAI semantic conventions are still in development status. By building the span model ourselves, you learn what OpenTelemetry captures without depending on experimental libraries. The attribute names (gen_ai.usage.input_tokens, gen_ai.usage.output_tokens) follow the official naming convention, so migrating to the SDK later is straightforward.

  • Save argus/agent/graph.py.

You won't see a change yet. The next substep wires this into an API endpoint you can call.

Seeing import errors in your editor?

Make sure argus/agent/__init__.py exists. Without it, Python does not recognize argus/agent/ as a package.

Create the /agents/run endpoint

The agent and tracing layer are built. Now you need an API endpoint that accepts an input message, runs the traced agent, and persists the resulting spans to PostgreSQL so you can inspect them later.

  • Create the evaluation package directory. You will expand this in the next step, but the endpoint needs a helper function from it now:
mkdir -p argus/evaluation
touch argus/evaluation/__init__.py
  • Create a new file called argus/evaluation/runner.py and add the parse_model_responses helper function:
import uuid

from argus.agent.mock_model import MockChatModel, MockModelResponse, MockToolCall

def parse_model_responses(raw: list[dict]) -> list[MockModelResponse]:
    # Convert raw JSON dicts into typed MockModelResponse objects
    responses = []
    for r in raw:
        tool_calls = []
        for tc in r.get("tool_calls", []):
            tool_calls.append(MockToolCall(
                id=tc.get("id", str(uuid.uuid4())),
                name=tc["name"],
                args=tc.get("args", {}),
            ))
        responses.append(MockModelResponse(
            content=r.get("content", ""),
            tool_calls=tool_calls,
            prompt_tokens=r.get("prompt_tokens", 50),
            completion_tokens=r.get("completion_tokens", 30),
        ))
    return responses

What does this code do?

parse_model_responses bridges the API layer and the agent. The endpoint receives raw JSON dicts from the request body. This function converts them into typed MockModelResponse objects that the MockChatModel can use.

  • Save argus/evaluation/runner.py.

Now update the main application file to wire everything together.

  • Replace the entire contents of argus/main.py with the following:

  • AgentRunRequest defines the request shape: the input message, scripted model responses, and optional tool failure modes.
  • POST /agents/run parses responses, runs the agent, serializes all spans to JSON, and inserts the trace into the traces table.
  • GET /traces/{trace_id} retrieves a stored trace by ID so you can inspect the full span hierarchy.
  • Save argus/main.py.
  • The FastAPI dev server should auto-reload. Check the terminal running fastapi dev argus/main.py to confirm it reloaded without errors.

Server showing an import error?

Make sure argus/evaluation/__init__.py exists. Also confirm that argus/agent/__init__.py exists. Both are required for Python to recognize the subpackages.

help me fix import errors in my Argus FastAPI app

Now test the endpoint by sending a request that triggers a tool call.

  • Open a new terminal and run this curl command to test the /agents/run endpoint:
curl -s -X POST http://localhost:8000/agents/run \
  -H "Content-Type: application/json" \
  -d '{
    "input": "What is Python asyncio?",
    "model_responses": [
      {"content": "", "tool_calls": [{"id": "call-1", "name": "search_knowledge_base", "args": {"query": "python async"}}]},
      {"content": "Python asyncio provides concurrent execution using async/await syntax."}
    ]
  }' | python -m json.tool

You should see a JSON response containing a trace_id, an output field with the asyncio answer, and steps showing 2 (one model call that triggered a tool, then a second that returned the final answer).

  • Verify the trace was stored by fetching it. Copy the trace_id from the response above and run:
curl -s http://localhost:8000/traces/[[TRACE_ID="the trace_id from the previous response"]] | python -m json.tool

The response should show a spans array containing a root span named agent_execution, child spans named model_call_1 and model_call_2, and a tool_search_knowledge_base span between them.

Getting a 422 Unprocessable Entity?

Check that your JSON body matches the AgentRunRequest schema exactly. The model_responses field must be a list of objects, and each tool call object needs id, name, and args fields.

Your agent is instrumented and every execution is permanently recorded. Next, you will build an evaluation engine that runs this agent against full test suites and classifies any failures into structured categories.

Build the Evaluation Engine and Failure Classifier

Your agent is instrumented and producing traces. Now you need a way to systematically test it against known inputs and determine why failures happen, not just that they happened.

In this step, you will build the core evaluation engine that runs your agent against a structured test suite, computes reliability metrics, classifies every failure into a specific category using deterministic signals, and exposes everything through REST endpoints.

In this step, get ready to:
  • Create a test dataset with 15 cases covering basic, adversarial, and failure scenarios.
  • Build an evaluation runner that computes success rate, hallucination rate, tool accuracy, and latency metrics.
  • Add a deterministic failure classifier, reliability scoring, regression detection, and connect all experiment endpoints.
Define the test dataset and create the failure classifier

Evaluation needs known-good test cases to compare against. Each test case defines the input, expected output, which tools should be called, and tags describing the scenario type.

  • Create a datasets directory in your project root by running this command:
mkdir datasets
  • Create datasets/test_suite.json and paste the following 15 test cases:

What does this dataset cover?

The 15 test cases span four categories:

  • Basic cases (tc-001 through tc-004, tc-007, tc-009, tc-014, tc-015): straightforward queries where the agent should succeed.
  • Edge cases (tc-006, tc-008): inputs that push tool boundaries.
  • Adversarial cases (tc-005, tc-012): prompt injection attempts that the agent should refuse.
  • Failure scenarios (tc-010, tc-011, tc-013): injected tool failures and wrong tool selection.

Each case includes scripted model_responses so the MockChatModel produces deterministic outputs. Some cases include tool_fail_modes to trigger infrastructure failures.

  • Save datasets/test_suite.json.
  • Confirm the file exists by running:
ls datasets/

You should see test_suite.json in the output.

Now create the failure classifier. This module examines trace data from failed test cases and assigns each failure a structured category based on deterministic signals.

  • Create the argus/evaluation/ package by running:
mkdir -p argus/evaluation
touch argus/evaluation/__init__.py
  • Create argus/evaluation/classifier.py with the following code:

# Regex patterns that detect prompt injection attempts in user input

What does this classifier do?

The classifier uses a priority-ordered chain of deterministic checks. It inspects trace spans for errors, counts agent steps, matches regex patterns against the input, and compares tool usage against expectations.

Each check returns early with a category and the specific signals that triggered it. This makes failures debuggable without needing a second LLM call to judge the first one.

Why deterministic signals instead of LLM-as-judge?

An LLM-as-judge approach introduces its own failure modes into your evaluation pipeline. A judge model can hallucinate, misclassify, or disagree with itself across runs. Deterministic signal extraction (regex, set comparison, span status) is reproducible, fast, and zero-cost.

  • Save argus/evaluation/classifier.py.

What does this code do?

  • TestCase mirrors the JSON schema of each entry in your test suite. It holds the input, expected output, which tools should be called, and scripted model responses.
  • TestResult captures the outcome of a single agent run, including whether it passed, what tools were invoked, and any failure classification.
  • ExperimentMetrics aggregates results across all test cases into the metrics you will expose via the API.
  • parse_model_responses() converts raw JSON dictionaries from the request body into typed MockModelResponse objects the agent can consume.
  • Add the helper functions below the parse_model_responses function in the same file:
def evaluate_output(actual: str, expected: str) -> bool:
    """Check if expected output is a substring of actual output (case-insensitive)."""
    return expected.lower().strip() in actual.lower().strip()

What does this code do?

  • evaluate_output() checks success by verifying the expected output appears as a substring of the actual output.
  • extract_tools_called() and get_tool_results() mine the trace spans for tool usage data.
  • detect_hallucination() flags outputs where more than 50% of meaningful words are not found in the input or tool results. This is a heuristic signal, not a definitive judgement.

What does run_evaluation do?

For each test case, the function creates a fresh MockChatModel from the scripted responses, runs the traced agent, and evaluates the output against expectations. It tracks successes, tool accuracy, hallucinations, and loop failures as it iterates.

After all cases complete, it computes aggregate metrics including p95_latency_ms (the 95th percentile latency) and total_estimated_cost (based on token counts at a fixed per-token rate).

Seeing import errors?

If your dev server shows an import error for argus.evaluation.classifier, make sure you created the argus/evaluation/__init__.py file. Python requires it to recognize the directory as a package.

What does this code do?

  • compute_reliability() computes a weighted composite score: 40% correctness (success rate), 20% robustness (resistance to adversarial inputs), 20% latency performance, and 20% cost efficiency.
  • detect_regression() runs a two-proportion z-test comparing two experiments. If the candidate's success rate is significantly lower (p < 0.05), it flags a regression.
  • Save argus/evaluation/reliability.py.

What does the updated main.py add?

  • POST /datasets and GET /datasets/{dataset_id} let you upload and retrieve test suites.
  • POST /experiments runs the full evaluation pipeline: loads the dataset, runs every test case, computes metrics, classifies failures, computes reliability, logs to MLflow, and stores everything in PostgreSQL.
  • GET /failures/{experiment_id} returns the failure distribution grouped by category.
  • GET /reliability/{experiment_id} returns the composite reliability score breakdown.
  • POST /experiments/compare performs the z-test regression check between a baseline and candidate experiment.
  • Save argus/main.py.
  • The FastAPI dev server should auto-reload. Verify the new endpoints are registered by opening http://localhost:8000/docs in your browser.

You should see all the new endpoints listed in the Swagger UI: /datasets, /experiments, /failures/{experiment_id}, /reliability/{experiment_id}, and /experiments/compare.

Now test the full pipeline end-to-end. Upload the dataset and run an experiment by running these commands:

curl -s -X POST http://localhost:8000/datasets \
  -H "Content-Type: application/json" \
  -d "{\"name\": \"test-suite\", \"test_cases\": $(cat datasets/test_suite.json)}"

You should see a JSON response with an id field. Copy that dataset ID, then run an experiment against it:

curl -s -X POST http://localhost:8000/experiments \
  -H "Content-Type: application/json" \
  -d '{"dataset_id": "[[DATASET_ID="your dataset ID from the previous response"]]", "agent_config": {"version": "v1"}}'

The response should contain metrics (success_rate, hallucination_rate, tool_selection_accuracy), failure_distribution (grouped by category), and a reliability_score composite breakdown.

Getting a 404 or connection error?

If you see a connection refused error, check that the FastAPI dev server is still running. If the server crashed on reload, look at the terminal for import errors. The most common cause is a missing __init__.py in the argus/evaluation/ directory.

If you get a 404 on POST /experiments, make sure you are using the dataset ID from the previous response, not a placeholder.

help me debug my evaluation endpoint

✔️ Awesome, I've got everything!

Great. Double check you have saved argus/main.py before continuing.

ⓧ I'd like to double check the full code

Your evaluation engine is fully operational. You can now run any agent configuration against a test suite and get structured failure analysis, reliability metrics, and statistical comparisons. Next up, you will verify experiment tracking in MLflow and test the regression detection endpoint with a second experiment run.

Secret mission

Adversarial Testing Engine and CI Reliability Gate

Your evaluation platform can measure reliability, but can it defend against attacks? Build an adversarial testing engine that generates prompt injections, tool failures, and input mutations. Then wire it into a CI reliability gate that blocks deployment when agent quality regresses.

Clean Up Your Resources

Clean Up Your Resources

Decide whether to keep your resources running, pause them to come back later, or delete them entirely. This project runs entirely locally via Docker, so there are no ongoing costs.

Resources you used:

  • Docker containers: PostgreSQL, Redis, MLflow.
  • Docker volumes: pgdata and mlflow_artifacts.
  • Data stored in PostgreSQL (traces, experiments, datasets).
  • Project folder (argus) on your Desktop with source code and Python virtual environment.

Keep everything running

No action needed. Choose this if you're still actively building or experimenting with different agent configurations.

  • Your Docker containers continue running in the background and are accessible at the same ports.
  • The FastAPI server can be restarted anytime with fastapi dev argus/main.py.
  • MLflow UI remains available at http://localhost:5001.

Pause - I'll come back to this later

Shut down running containers to free up system resources. Your data and volumes are preserved so you can pick up where you left off.

  • Stop the FastAPI dev server by pressing Ctrl+C in its terminal.
  • Stop the Docker containers by running this command from your argus project folder:
docker compose stop
  • When you're ready to resume, run docker compose start to bring the containers back with all your data intact.

Delete - I don't want to use this again

Remove all project resources and start fresh. This permanently deletes all stored traces, experiments, and datasets.

  • Stop the FastAPI dev server by pressing Ctrl+C in its terminal.
  • Remove all Docker containers and their associated volumes by running this from your argus project folder:
docker compose down -v
  • This removes the PostgreSQL, Redis, and MLflow containers along with the pgdata and mlflow_artifacts volumes.
  • Deactivate your Python virtual environment:
deactivate
  • Delete the project folder entirely. On macOS/Linux:
cd ~/Desktop
rm -rf argus
  • On Windows:
cd ~\Desktop
rmdir /s /q argus

Nice Work!

Nice Work!

You just built Argus, a production-grade AI agent evaluation platform that instruments, tests, classifies, and compares agent behavior across versions.

You've learned how to:

  • Instrument agent execution with OpenTelemetry tracing, capturing model calls, tool usage, token counts, and latency across a LangGraph agent loop.
  • Build an evaluation engine that computes success rate, tool accuracy, hallucination rate, and cost metrics, with deterministic failure classification using signal extraction instead of LLM-as-judge.
  • Integrate MLflow for experiment tracking with version comparison and statistical regression detection using a two-proportion z-test.
  • Built an adversarial testing engine with prompt injection, tool failures, and task mutation, plus a CI reliability gate that blocks deployment when agent quality regresses (Secret Mission).
